We explore spatal, temporal socal effects n sparse aggregated (area-level) hgh-dmensonal dsaggregated (event-level) data for New York Los Angeles. Focusng on nference, we apply Gradent Boostng Rom Forests to assess predctor mportance, as well as Gaussan Processes to model spatal dspartes n reportng tmes. Our results hghlght dfferences smlartes between the two ctes. We dentfy at-rsk populatons communtes whch may be targeted wth focused polces nterventons to support rape vctms, apprehend perpetrators, prevent future crmes. 1 Introducton Wth the Harvey Wensten scal the #metoo hashtag campagn, 2017 brought the attenton of the general publc once agan to the ssue of sexual volence. Whle the last decades have shown progress on destgmatzaton, vctms of sexual volence stll suffer from substantal socal repercussons. Ths manfests tself n extremely low reportng numbers for sexual crme, the most severe of whch s rape. In 2012, a survey conducted by the parentng forum mumsnet found that 10% of women had been raped 35% had been sexually assaulted [1]. Compoundng the problem s only a small proporton of rape crmes are reported to polce: the Rape, Abuse & Incest Natonal Network (RAINN) estmates that only around 30% of all sexual assault s reported [2], our analyss of New York Cty crme data (descrbed below) reveals that approxmately 30% of rapes that were reported to polce had a lag of 30 days or more between occurrence reportng tme. Gven the substantal problem of under-reportng, t s of crucal mportance to underst the underlyng process of reportng sexual volence n general, rape n partcular. Ths ssue s reterated by a recent study that showed that the longer a vctm hestates to report, the more unlkely t becomes for the crme to be reported at all [3]. Addtonally, reportng delays complcate nvestgaton efforts, makng t more dffcult to convct perpetrators. Wth ths study, we seek to tackle the problem of delayed rape reportng from a machne learnng (ML) perspectve. In recent years, ML has emerged as a powerful toolkt for crmnology research [4], for nstance helpng to predct domestc volence [5]. We apply Rom Forests Gradent Boostng to assess the mportance of multple socoeconomc temporal factors n predctng reportng tme. We observe substantal spatal dependence, thus applyng Gaussan Processes to model the correlaton structure to examne whether there s resdual spatal dependence, after controllng for neghborhood-level demographc socoeconomc features. Ths paper contrbutes to current research by provdng a new dataset of predctors of rape reportng delays compled from open data sources, exposng spatal varaton n rape reportng gatherng novel nsghts nto the mportance of spato-temporal socoeconomc factors. Subsequently, we ntroduce our dataset, test for spatal temporal effects, present the results for our predctve models fnally suggest potental future research drectons. 2 Data We access hstorcal crme records for New York Cty (NYC) Los Angeles (LA), from ther open-data portals. To ensure a suffcent sample sze for regonal aggregaton, we extract rape crmes from 2012 to To ensure representatveness of our predctors, we select only rape whch occurred n the domestc or professonal space,.e. where we can assume that vctm perpetrator were acquanted. Ths amounts to a total of 7,242 reported rapes for NYC 4,649 for LA. Note that whle we expermented wth shorter tme perods as well (due to the statc nature of our predctors), model performance dd not vary substantally. For each crme we compute the reportng delay n days t = tocc trep as the dfference between the day the crme occurred the day t was reported to authortes. We then create bnary values ndcatng whether a crme was reported wthn one day or wthn one month respectvely: 1, f t 1 1, f t 30 month dday = d = (1) 0, otherwse 0, otherwse The LA crmes come wth pont locaton data for each rape case, normalzed to block level. We can hence use these ponts wthout further processng for our dsaggregated model. The NYC data, however, comes wth polce precncts as the most granular geography. For each of the 77 NYC precncts, we compute the proporton of crmes reported wthn the two selected ntervals P P pday = m1 dday pmonth = m1 dmonth, where m represents the number of observed rapes n each area. We also create an aggregated dataset for LA, aggregatng on the polce department s basc car dstrct level (169 basc car dstrcts n total). Each of these three datasets (aggregated NYC, aggregated LA, dsaggregated LA) were enrched wth the followng features: demographc (age, sex, race), housng (household sze, occupants per room, sngle households, rent as percentage of ncome), educaton (hgh-school degrees) economc (ncome, unemployment, nsurance). For the dsaggregated dataset, we collect statstcs from the census tract wthn whch the crme was commtted. For the aggregated data, we apply populaton-weghted data aggregaton from census tracts to polce precncts (NYC) or basc car dstrcts (LA). Lastly, the LA data provdes nformaton on the vctm s age, gender ethncty whch we use n the dsaggregated model Results Spatal Temporal Effects We start our analyss by examnng geographcal temporal patterns n rape reportng delays. Our hypothess s that reportng delays are n fact not..d., but rather exhbt spatal temporal 2

We measure local spatal autocorrelaton for the proportons p of crmes reported wthn the ntervals {day, month} usng the Local Moran s I statstc [7], defned as p p I = (n 1) m k=1,k w,k(p k p) 2 m k=1,k w,k (p k p) (2) where p represents the mean of p w,k represents the spatal weght between the features k. We assume smple weghts for neghbourng non-neghbourng areas of each dstrct, where w,k = 1 f k s a neghbour of w,k = 0 otherwse. The Local Moran s I statstc corresponds to a (pseudo) p-value ndcatng the sgnfcance of the spatal correlaton. Both NYC LA exhbt hot spots of spatal autocorrelaton, confrmng our ntal hypothess (see Fgure 1). There are (at least) two possble explanatons for ths: (1) an underlyng socal process dsgused as a spatal process (e.g., reportng delays are drven by socoeconomc factors that vary over space), or (2) a true spatal process (e.g., a contagous spread of rape reportng behavor over space). We address ths queston n the next secton. Frst, however, we assess the temporal dmenson. Agan, our hypothess s that temporal features affect rape reportng delays. In partcular, we examne whether rapes that occurred on weekends, holdays or durng dfferent seasons exhbt varyng reportng delays. Fgure 2 shows medan reportng delays by respectve reportng month occurrence day. Several of the observed spkes rregulartes can be explaned wth common polcng practces. For nstance, for rapes where the vctm cannot remember the exact occurrence date (due to trauma or long reportng delay), the frst or mddle day of a month s recorded as occurrence day. Ths practce s consstent for NYC LA. However, we do fnd nterestng patterns from the graphcal analyss: Holdays (partcularly those hghlghted n Fgure 2) exhbt hgher medan reportng delays. Note that ths pattern of longer delays does not seem to correspond to more overall rapes durng these days. Beyond holdays, rapes reported at the begnnng end of each year appear to be reported later. We hence decde to nclude both spatal temporal features n our predctve model for reportng delays. 3.2 Predctve Modelng Aggregated model: We model the aggregated data n a two-step process. Frst, we estmate our output p {day,month} as a functon of socal features, p f(x)+ɛ where x represents a matrx of socal features ɛ gves the model resduals. We then seek to predct the resdual error term ɛ f(g) usng spatal context, where g represents the centrod coordnates of each area to solate addtonal spatal effects that are not explaned by the varaton n observed demographc socoeconomc features. We apply ths to aggregate data from NYC LA, excludng temporal features whch are measured at dsaggregated case level only. Step 1 s carred out usng Rom Forests Gradent Boostng (choosng the best predctor by cross-valdaton each tme), Step 2 uses Gaussan Processes wth radal bass functon (RBF) kernels to learn from spatal context [8]. We apply Leave-One-Out Cross-Valdaton (LOO-CV) to valdate the predctons. Our results are shown n Table 1. For NYC, we can explan around 20% of the total varaton n the data usng socal features. Spatal context explans another 10% of the remanng varaton. In LA, the explanatory power of socal features drops slghtly whle spatal context does not further mprove the predctons. Lookng at varable 3

Afrcan-Amercan communtes are assocated wth shorter reportng delays, whle Hspanc communtes are assocated wth longer reportng delays. These fndngs are consstent across both ctes. Dsaggregated model: We model dsaggregated data as a classfcaton problem where we seek to predct each case s bnary ndcators d {day,month} as defned n secton 2. These are modelled as a functon d f(c, z, x, v) where x represents socal features for the census tract a rape occurred n, z represents temporal features (holday, weekend,...) specfc to the occurrence date, v represents vctm-specfc nformaton c represent the coordnates of crme locaton (normalzed on block level). We use Gaussan Process, Rom Forest Gradent Boostng classfers to apply ths model to the LA data. Due to the large sample sze, we use 10-fold cross valdaton nstead of LOO-CV to verfy the results, whch are gven n Table 2. We acheve our best predcton accuracy wth an AUC of nearly 0.7 for p month from a model ncludng all avalable features. Varable mportance measures confrm fndngs from the aggregated model also demonstrate that vctm age s by far the best sngle predctor of reportng delay, whch s n lne wth prevous fndngs [9]. Despte suspected patterns, temporal features do not appear to be of partcular relevance for ths analyss. 4 Concluson In ths paper, we present a machne learnng approach to predct reportng delays of rape crme. We tran event-level (dsaggregated) area-level (aggregated) models wth spatal, temporal socoeconomc predctors gathered for the ctes of New York Los Angeles. Our fndngs suggest that economc factors temporal features have relatvely low, housng characterstcs relatvely hgh, explanatory power. We fnd substantal evdence for spatal patterns n rape reportng, whch we account for usng Gaussan Processes to model covarance structures. Whle these results may already serve authortes n talorng polces communty-polcng strateges, further efforts should be undertaken to deepen the understng of rape reportng processes. Bayesan approaches comng wth more generalzable nference mght be partcularly valuable. We explore the temporal dmenson of rape reportng usng statc features only, whch could be approved upon usng a dynamc approach. Ths way, effects of events such as the #metoo campagn could also be nvestgated. As only some of our socoeconomc predctors appear relevant, more features quantfyng cultural nfluences (e.g., socal stgma) should be tested. Lastly, workng wth open data sources lmts the avalable nformaton s not fully representatve of the data avalable to authortes. Workng wth detaled vctm perpetrator data mght help to further solate vulnerable subgroups who could be supported wth targeted communty-based nterventons. Nevertheless the potental threat of vctm redentfcaton from open data should also be addressed. 4
